5.3 Loss = surprise

Two weather forecasters both said “70% rain”. It rained. Who’s better? You can only tell by scoring many forecasts against what actually happened. A language model is a forecaster for the next letter, and today you build its scorecard.

1Watch

After each real pair, ask: what chance did the model give to the letter that actually came next? Turn that chance into a surprise: surprise = −log(chance). (Here “log” always means the natural log, written ln and computed with Python’s math.log, not the base-10 log from school.)

  • A sure thing (chance 1) → surprise 0.
  • A coin flip (chance 0.5) → surprise 0.69.
  • A one-in-a-thousand event → surprise 6.9.

Why a log? Chances of several events multiply; their surprises add, which is much easier to average. Average the surprise over all 228,146 pairs in the dataset and you get one number: the loss. For the counting model it’s 2.454. Lower is better, and every model in this course will be judged by it.

That settles the forecasters too: one “70% rain” proves nothing, but the forecaster with the lower average surprise over many days is the better one. That average is exactly the loss.

One problem shows up straight away: a pair the model has never seen has chance 0, and −log(0) is infinite. Lesson 5.4 fixes that.

Two blanks:

  1. surprise(p): minus the natural log of p.
    Show me the linereturn -math.log(p)
  2. average_surprise: the average of every pair’s surprise over the whole dataset. Careful: average over pairs, not over names.

When it’s right, the dataset loss prints as 2.454, the number on the scoreboard.

def chance(a, b):
    """The model's chance that b comes right after a."""
    return counts.get((a, b), 0) / totals[a]

def surprise(p):
    """Sure things (p = 1) are no surprise; rare things are a big one."""
    return 0 # TODO: minus the natural log of p (math.log)

def name_surprises(name):

print('emma:', [round(s, 2) for s in name_surprises('emma')])
print('andrej:', [round(s, 2) for s in name_surprises('andrej')])
print('loss over the whole dataset:', round(average_surprise(docs), 4))

4Check yourself

1. Predict: what does surprise(0.9) print?
2. In “andrej”, which pair surprises the counting model most?
3. Model A has loss 2.45, model B has loss 2.28. Which predicts better?

Lines 167 to 169 are exactly this lesson. loss_t = -probs[target_id].log() is the surprise at one position, the losses are collected, and line 169 averages them. Karpathy’s comment on that line: “May yours be low.”
