6.1 One knob

ChatGPT-class models have billions of knobs. microgpt has 4,192. Before we turn thousands, let’s understand what “learning” means with exactly one.

1Watch

A model is a machine with knobs (in AI language: parameters). Its predictions depend on where the knobs are set. Learning means turning the knobs until the loss is as low as it goes.

Our one-knob model answers a single question: what’s the chance a name starts with “a”? Call the knob p. The model gives “a” chance p and “anything else” chance 1 − p, so a name starting with “a” costs −log(p) and a name starting with “k” costs −log(1 − p). Score any setting with the loss from 5.3, the average surprise over all 32,033 first letters. Plot the loss for every setting and you get a valley. The lowest point is the best setting.

The bottom sits at exactly 4,410 / 32,033 = 0.1377, the same answer counting gives. That’s the big idea: minimising surprise rediscovers counting. But a model with knobs can do things a count table can’t, like share what it learns between similar letters (lesson 6.5).

With one knob you can draw the whole valley and look. With 4,192 knobs the valley has 4,192 dimensions: no picture, no looking. You need to feel your way downhill. That’s the next lesson.

p = 0.500
loss 0.6931
00.250.50.7510.511.52knob p = chance a name starts with “a”

3Build

loss(p) is written for you. Fill the loop in best_setting(): try every knob setting from 0.001 to 0.999 and keep the one with the lowest loss. best holds the winner so far; when a setting beats it, that setting becomes the new best. This brute-force search is exactly what we can’t afford with thousands of knobs, so remember how many settings you tried.

import math

docs = [line.strip() for line in open('names.txt') if line.strip()]
N = len(docs)                                   # 32,033 names
starts_with_a = sum(1 for d in docs if d[0] == 'a')   # 4,410 of them

# The whole model is ONE knob: p = the chance that a name starts with 'a'.
# 'a' gets chance p and 'anything else' gets 1 - p, so a name starting
# with 'k' costs -log(1 - p). The loss is the average over all first letters.
def loss(p):
    surprise_if_a = -math.log(p)
    surprise_if_not = -math.log(1 - p)
    return (starts_with_a * surprise_if_a + (N - starts_with_a) * surprise_if_not) / N

# Turn the knob through every setting and keep the one with the lowest loss.
def best_setting():
    settings = [i / 1000 for i in range(1, 1000)]   # 0.001, 0.002, ..., 0.999
    best = settings[0]
    for p in settings:
        pass # TODO: if loss(p) is lower than loss(best), p is the new best
    return best

for p in [0.05, 0.1, 0.2, 0.5]:
    print(f'p = {p}: loss {loss(p):.4f}')
best = best_setting()
print('best knob setting:', best, ' counting says:', round(starts_with_a / N, 4))

4Check yourself

1. In AI, a “parameter” is…
2. Predict: if 8,000 of the 32,033 names started with “a”, what would best_setting() print?
3. Why can’t microgpt just try every setting like best_setting() does?

5Unlocked in microgpt

No new lines yet: the knob idea runs through all of microgpt. Every one of its 4,192 knobs lives in one list, params (line 89), which you met in lesson 2.3.
