9.1 Multi-head attention

One attention head can only ask one question at a time. microgpt runs four heads side by side, each with its own slice of the query, keys and values, so each letter can look back in four different ways at once.

microgpt’s vectors have 16 numbers. Multi-head attention cuts the query, every key and every value into 4 slices of 4 (the heads). Head 1 takes the first 4 numbers, head 2 the next 4, and so on. Each head runs the attention from 8.3 on its own slice: scores, softmax, blend.

The four 4-number results are glued back into 16 numbers, and one more learned matrix, attn_wo (the output projection), mixes them together. Same total size and the same number of multiplications (plus four small softmaxes instead of one), but four independent attention patterns instead of one.

The heatmaps show the four real heads of the trained model. Notice they differ: training gave each head different query and key slices to work with. In a model this small the differences are subtle; in big GPTs, heads specialise much more clearly.

Press 1 head × 16 numbers to see the alternative: one search over all 16 numbers. Each letter then gets one attention pattern instead of four, so it can only look for one kind of thing at a time.

Two blanks in multi_head: slice every key and value to this head’s 4 numbers, and add the head’s 4 blended numbers to the end of out. Use out.extend(...), which adds the 4 numbers; out.append(...) would add one 4-number list. The demo then applies attn_wo, and the last check compares the result with microgpt’s on the real model.
